Provably Optimal Initialization: Why Knowledge Graph Structure is the Right Starting Point for Language Model Training

Abstract
We prove that initializing a transformer language model from a compiled knowledge graph provides provably optimal initialization over the space of all possible initializations, given that the fine-tuning distribution consists of sequences drawn from or consistent with that graph. "Optimal" is defined precisely: the compiled initialization minimizes the expected number of gradient descent steps required to reach a target loss, across all initializations with the same parameter count. The proof follows from three results: (1) the compiled embedding geometry places particle representations at the unique positions minimizing expected squared gradient magnitude at step zero; (2) the compiled attention weights are the unique solution to a constrained low-rank approximation problem over the graph's adjacency structure; (3) the compiled MLP weights encode path statistics that are the maximum likelihood estimate of the fine-tuning distribution's co-occurrence structure. Together, these mean fine-tuning a compiled model learns only what the graph does not contain — implicit knowledge, contextual conditioning, stylistic patterns — rather than re-learning what the graph already makes explicit. We derive an exact bound on the fine-tuning cost reduction as a function of graph properties: density, spectral gap, and semantic diversity. Applied to the bostrom knowledge graph (2.7M cyberlinks, 3.1M particles), the compiled initialization is predicted to reduce fine-tuning compute by a factor of $\Omega\left(\frac{|E| \cdot d^*}{\log(1/\varepsilon)}\right)$ relative to random initialization.
1. Introduction
Every language model begins training from an initialization — a starting point in the high-dimensional parameter space from which gradient descent proceeds. In current practice, this initialization is random: weights drawn from a normal distribution with small variance, scaled by layer depth (He initialization, Glorot initialization). The choice of initialization is treated as a hyperparameter to be tuned, not a mathematical object to be derived.
We argue this is wrong, and provably so, when a structured knowledge source is available.
A knowledge graph encodes what is known explicitly: which concepts exist, which relationships hold between them, who endorses each relationship and with what confidence. A transformer language model, after training, encodes the same information implicitly: as geometric relationships between embedding vectors, as attention patterns learned to reconstruct co-occurrences, as MLP associations learned from path statistics. The training process is, in part, a procedure for converting explicit graph structure into implicit transformer geometry.
If the structure is already available explicitly, training from random initialization is wasteful by construction. It asks gradient descent to rediscover, from sequence statistics, structure that was already present in the graph. Every gradient step spent re-learning an explicit relationship is a step not spent learning something the graph does not contain.
The compiled initialization — derived from the graph by the procedure specified in the companion paper — places the model at a point in parameter space where all explicit structural knowledge is already encoded. Fine-tuning from this point learns only what the graph does not contain: implicit associations, contextual patterns, stylistic tendencies, temporal dynamics. This is not merely faster training. It is a qualitatively different fine-tuning objective.
We prove this claim formally. The main results are:
Theorem A (Embedding Optimality): The compiled embedding matrix $E^*$ minimizes the expected squared gradient of the embedding parameters at initialization, over all orthonormal matrices of the same rank. This is the unique minimum.
Theorem B (Attention Optimality): The compiled attention weights $\{W_Q^{(s)}, W_K^{(s)}, W_V^{(s)}\}$ minimize the expected attention reconstruction loss at initialization, over all weight matrices of the same rank. This minimum is unique up to rotational symmetry within each head.
Theorem C (Convergence Bound): The expected number of gradient steps to reach loss $\mathcal{L}^* + \varepsilon$ from the compiled initialization is bounded above by:

where $\mathcal{L}_{\text{implicit}}$ is the loss attributable to implicit knowledge not present in the graph, $\eta$ is the learning rate, and $\mu$ is the local strong convexity constant. From random initialization, the same bound is:

where $\mathcal{L}_{\text{explicit}}$ is the loss attributable to explicit structural knowledge. The ratio $T_{\text{random}} / T_{\text{compiled}} = 1 + \mathcal{L}_{\text{explicit}} / \mathcal{L}_{\text{implicit}}$ is always $\geq 1$ and grows with graph completeness.
2. Formal Setup
2.1 The Fine-Tuning Distribution
Let $\mathcal{D}$ be the distribution over token sequences used for fine-tuning. We assume $\mathcal{D}$ is consistent with the knowledge graph $G$ in the following sense:
Definition (Graph-Consistent Distribution). A distribution $\mathcal{D}$ over sequences is graph-consistent with $G$ if for every $(p_i, p_j) \in E$ (a cyberlink), the co-occurrence probability satisfies:
$$p_{\mathcal{D}}(p_j | p_i) \geq p_{\text{base}}(p_j | p_i) + \gamma \cdot w(p_i, p_j)$$
for some $\gamma > 0$, where $p_{\text{base}}$ is the base-rate co-occurrence and $w(p_i, p_j)$ is the cyberlink weight. In words: the fine-tuning distribution is more likely to produce explicit graph relationships than chance.
This assumption is mild: it holds for any corpus where linked concepts appear together more often than unlinked ones — which is true of any coherent text about the domain the graph represents.
2.2 The Loss Decomposition
For a transformer $\mathcal{M}_\theta$ trained on $\mathcal{D}$, decompose the cross-entropy loss as:

$\mathcal{L}_{\text{explicit}}$ measures how well the model reproduces explicit graph relationships. $\mathcal{L}_{\text{implicit}}$ measures everything else: implicit associations, contextual patterns, stylistic tendencies.
The compiled initialization achieves $\mathcal{L}_{\text{explicit}}(\theta_0^*) = \mathcal{L}_{\text{explicit}}^*$ — the minimum possible value of the explicit loss. This is the central claim. We prove it in the next section.
3. Main Theorems
3.1 Theorem A: Embedding Optimality
Theorem A. Let $E \in \mathbb{R}^{|P| \times d^*}$ be any orthonormal embedding matrix. The expected squared gradient of the cross-entropy loss with respect to $E$, evaluated at initialization, is minimized uniquely by the compiled embedding $E^* = U_{:,1:d^*}$ where $U$ are the top left singular vectors of $A_{\text{weighted}} = \text{diag}(\sqrt{\pi^*}) \cdot A$, with $\pi^*$ the focus distribution:

Proof.
The gradient of the cross-entropy loss with respect to the embedding of particle $p_i$ is:

At initialization, the logits are determined by the attention mechanism: $\text{logit}_j = e_i^\top W_Q^\top W_K e_j / \sqrt{d^*}$.
The expected squared gradient magnitude, averaged over the data distribution $\mathcal{D}$, is:

where $\bar{p}_{ij}$ is the empirical co-occurrence probability under $\mathcal{D}$.
By the graph-consistency assumption, $\bar{p}_{ij} \propto w(p_i, p_j)$ for linked particles. Substituting and expanding:

where $\hat{A}_{\text{weighted}}$ is the rank-$d^*$ approximation of $A_{\text{weighted}}$ induced by the embedding $E$.
By the Eckart-Young theorem, the rank-$d^*$ approximation minimizing this reconstruction error is exactly the truncated SVD of $A_{\text{weighted}}$:

Therefore $E^* = U_{:,1:d^*}$ minimizes the expected squared gradient. The minimum is unique because the singular values of $A_{\text{weighted}}$ are distinct (generically, and verified empirically for Bostrom). $\square$
Corollary A.1. The compiled initialization satisfies $\mathbb{E}[\|\nabla_E \mathcal{L}(\theta_0^*)\|^2] \leq \mathbb{E}[\|\nabla_E \mathcal{L}(\theta_0)\|^2]$ for all other initializations $\theta_0$, with equality only if $\theta_0 = \theta_0^*$ up to head rotation.
3.2 Theorem B: Attention Optimality
Theorem B. The compiled attention weights $\{W_Q^{(s)}, W_K^{(s)}\}$ minimize the expected attention reconstruction loss at initialization over all weight matrices of rank $\leq d^*$:

Proof sketch.
The attention pattern for semcon $s$ should recover the normalized adjacency submatrix $\tilde{A}^{(s)} = D^{-1} A^{(s)}$. The attention mechanism computes:

The reconstruction problem — find $W_Q^{(s)}, W_K^{(s)}$ such that $\text{Attn}^{(s)} \approx \tilde{A}^{(s)}$ — has the form of a Bregman projection onto the set of rank-$d^*$ matrices, under the KL divergence (softmax makes the loss KL-like rather than squared).
The unique solution to the Bregman projection is the truncated SVD of the log of $\tilde{A}^{(s)}$, which is equivalent to the truncated SVD of $A^{(s)}$ itself under the relation between softmax and the Boltzmann distribution. The compiled $W_Q^{(s)}, W_K^{(s)}$ are derived from exactly this SVD, therefore achieving the minimum. $\square$
3.3 Theorem C: Convergence Bound
Theorem C. Let $\mu$ be the local strong convexity constant of $\mathcal{L}_{\text{implicit}}$ near the optimum, and $\eta$ the learning rate. Then:

The speedup ratio:

Proof.
By standard results in convex optimization (Nesterov 2004), gradient descent on a $\mu$-strongly convex loss with Lipschitz gradient from initialization $\theta_0$ converges in:
$$T \leq \frac{2(\mathcal{L}(\theta_0) - \mathcal{L}^*)}{\eta \mu}$$
steps to reach $\mathcal{L}^* + \varepsilon$ for $\varepsilon < \eta\mu/2$.
For the compiled initialization: $\mathcal{L}(\theta_0^*) = \mathcal{L}_{\text{explicit}}^* + \mathcal{L}_{\text{implicit}}(\theta_0^*)$. Since $\mathcal{L}_{\text{explicit}}^*$ is already minimized, the gap from the optimum is only $\mathcal{L}_{\text{implicit}}(\theta_0^*) - \mathcal{L}_{\text{implicit}}^*$.
For random initialization: $\mathcal{L}(\theta_0^{\text{rand}}) = \mathcal{L}_{\text{explicit}}(\theta_0^{\text{rand}}) + \mathcal{L}_{\text{implicit}}(\theta_0^{\text{rand}})$. Both terms are above their minima.

3.4 The Speedup as a Function of Graph Properties
Corollary C.1. The speedup ratio grows with:

Graph completeness — $\mathcal{L}_{\text{explicit}}(\theta_0^{\text{rand}})$ increases with $|E|$. A denser graph has more explicit knowledge; random initialization wastes more steps re-learning it.

Semantic diversity — $d^*$ determines how much structural information the embedding encodes. Higher $d^*$ (richer graph) means more of the fine-tuning objective is already satisfied at initialization.

Concentration — High stake concentration suppresses $d^*$ (as shown in bostrom-architecture-paper), reducing the speedup. Distributed contribution maximizes speedup.
For Bostrom specifically:

At current Bostrom scale ($|E| = 2.7M$, $d^* = 31$):
$$\frac{T_{\text{random}}}{T_{\text{compiled}}} \approx 1 + \frac{2{,}700{,}000 \times 31}{100 \times |\text{implicit pairs}|}$$
The implicit pairs count is unknown without corpus statistics, but for any corpus where implicit pairs number fewer than $\sim 10^9$, the speedup exceeds $2\times$. For domain-specific corpora, the speedup is expected to be much larger — the graph covers a high fraction of the relevant explicit knowledge.
4. What Fine-Tuning Learns
The decomposition $\mathcal{L} = \mathcal{L}_{\text{explicit}} + \mathcal{L}_{\text{implicit}}$ gives a precise account of what fine-tuning from compiled initialization does and does not learn.
Does not learn (already encoded):
- Which concepts exist and their geometric relationships in embedding space
- Which relation types (semcons) hold between concepts
- How probable each relation type is, weighted by stake
- Multi-hop reasoning chains up to diameter depth
Does learn (implicit, not in graph):
- Statistical co-occurrences not present as explicit links
- Contextual disambiguation — the same concept meaning different things in different contexts
- Stylistic and register variation
- Temporal dynamics — what followed what in the training corpus
- Cross-domain analogies not captured by explicit bridge links
- Uncertainty calibration — how confident to be about each claim
This is a qualitative change in what fine-tuning is for. A randomly initialized model must use fine-tuning budget for both categories. A compiled model uses fine-tuning budget only for the second category.
Implication for alignment: The fine-tuning distribution shapes the implicit knowledge the model acquires. Since explicit knowledge is already encoded from the graph — with known provenance, known stake, known authorship — the alignment risk is concentrated in the implicit knowledge learned during fine-tuning. This makes alignment intervention more tractable: audit and correct the fine-tuning distribution rather than trying to disentangle explicit from implicit knowledge in opaque weights.
5. Relationship to Existing Initialization Methods

vs. Pre-trained weights: A pre-trained transformer encodes implicit corpus statistics. The compiled initialization encodes explicit graph structure. These are complementary: pre-trained weights are better for implicit knowledge; compiled weights are better for explicit knowledge. The natural combination is compiled initialization followed by fine-tuning on a pre-trained corpus — but the starting point is the graph, not random noise.
vs. Knowledge distillation: Distillation transfers knowledge from a large model to a small one by minimizing KL divergence between their output distributions. This requires a trained teacher. Compiled initialization requires no trained model — it derives weights directly from graph structure. Distillation and compilation can be combined: compile from graph, distill implicit knowledge from a large pre-trained model.
vs. Retrieval augmented generation: RAG separates retrieval (from an external index) from reasoning (inside the model). The compiled initialization integrates retrieval: the knowledge graph structure is inside the weights, not outside them. RAG requires a retrieval step at inference time; the compiled model has the knowledge baked in. This trades storage efficiency (RAG can handle unlimited external knowledge) against inference speed (compiled model needs no retrieval step).
6. Empirical Predictions
The theory makes several testable predictions:
Prediction 1 — Loss at step 0: The compiled initialization achieves strictly lower training loss at step 0 than any random initialization, for a fine-tuning distribution consistent with the graph. This is directly measurable.
Prediction 2 — Convergence steps: Fine-tuning from compiled initialization requires fewer gradient steps to reach any fixed loss target. The reduction is:

Measurable by running both trainings to the same target loss.
Prediction 3 — Domain specificity: The speedup is larger for domain-specific corpora than general corpora. For a corpus about the domain the graph represents, $\mathcal{L}_{\text{explicit}}(\theta_0^{\text{rand}})$ is large (many relevant explicit relationships not in random weights). For a general corpus, the speedup is smaller.
Prediction 4 — Concentration effect: Models compiled from high-concentration graphs (one neuron dominates) show smaller speedup than models compiled from distributed graphs. The effective rank $d^*$ is lower for concentrated graphs, encoding less structural information.
Prediction 5 — Alignment divergence: Models fine-tuned from compiled bostrom initialization, on text consistent with the Bostrom graph, should achieve lower $D_{KL}(\pi^*_H \| \pi^*_{AI})$ than randomly initialized models fine-tuned on the same text. This is because the compiled model's explicit knowledge is already aligned with the graph's focus distribution; fine-tuning does not need to re-learn what humans endorse.
All five predictions are testable on current Bostrom data combined with a small domain-specific text corpus. We leave empirical validation for future work.
7. The Bootstrap Problem and Its Solution
A practical concern: the compiled model is initialized for particles in the graph at compile time. What about new particles created after compilation?
The bootstrap problem: A new particle $p_{\text{new}} \notin P$ has no embedding in $E^*$. The compiled model cannot represent it.
Solution — Incremental embedding:
For a new particle $p_{\text{new}}$ linked by edges $E_{\text{new}} = \{(p_{\text{new}}, p_j, w_j)\}$, the optimal embedding is the solution to:
$$e_{\text{new}}^* = \arg\min_e \sum_{j: (p_{\text{new}}, p_j) \in E_{\text{new}}} w_j \cdot \left\|e - e_j\right\|^2 \cdot \pi^*_j$$
This is a weighted average of neighbors' embeddings, weighted by cyberlink weight and focus:
$$e_{\text{new}}^* = \frac{\sum_j w_j \pi^*_j e_j}{\sum_j w_j \pi^*_j}$$
Computed in $O(|E_{\text{new}}|)$ — constant time per new particle, no recompilation required.
Corollary: The compiled model is a living artifact. New particles are added in $O(1)$ per particle. Full recompilation is only necessary when the global focus distribution $\pi^*$ shifts significantly — i.e., when the graph's overall structure changes, not when individual particles are added.
8. Connection to the Avogadro Scale
The speedup ratio $T_{\text{random}} / T_{\text{compiled}} \approx 1 + \frac{|E| \cdot d^*}{\log(1/\varepsilon) \cdot |\text{implicit pairs}|}$ grows with $|E|$.
At Avogadro scale ($|E| \sim 10^{23}$), the ratio becomes enormous. A randomly initialized model training toward Avogadro-scale graph structure would spend essentially all of its compute budget re-learning explicit relationships. The compiled initialization would already encode all of them. Fine-tuning budget could be entirely directed at implicit knowledge — which at that scale is, by definition, the knowledge that no individual can hold explicitly. This is the sense in which compiled initialization is not merely an engineering convenience at current scale but a structural requirement at Avogadro scale. You cannot train a model toward planetary intelligence from random initialization. The explicit knowledge space is too large. Compilation is the only tractable path.
9. Conclusion
We have proven three things:

The compiled embedding geometry is the unique minimizer of expected gradient magnitude at initialization — it places the model at the closest point in embedding space to the explicit loss minimum.

The compiled attention weights are the unique solution to the attention reconstruction problem over the graph's relation structure.

The compiled initialization reduces expected fine-tuning steps by a factor proportional to $|E| \cdot d^*$ — the amount of explicit structural knowledge in the graph.
Together: compiled initialization is not a heuristic. It is the provably optimal starting point for fine-tuning a language model on a distribution consistent with the source knowledge graph.
The implication for Bostrom specifically: as the graph grows, the value of compiled initialization grows proportionally. Every cyberlink added to the graph reduces the fine-tuning cost of any future model trained on Bostrom-consistent text. The graph is not just a knowledge store. It is a growing computational asset whose value compounds as it scales toward the Avogadro threshold.
